What Theoretical Guarantees Do We Have for Graph Partitioning?

Theoretical guarantees on balanced-minimizing-edge-cut graph partitioners

Graph partitioning is widely used in sparse matrix solvers, especially through nested dissection, METIS-style multilevel partitioning, SCOTCH, AMD, and newer parallel AMD variants. The key point is simple: current theory does not prove that practical tools such as METIS, SCOTCH, AMD, or ParAMD produce optimal orderings in general. Instead, the strongest guarantees apply to nearby mathematical problems, such as balanced vertex separator, sparsest cut, treewidth, and minimum fill-in.

For sparse direct solvers, the closest theoretical path is:

This path is clean when every recursive subgraph has a small balanced separator. For example, planar or two-dimensional grid-like graphs have separators of size O(n)O(\sqrt{n}). Under this condition, nested dissection gives the classical O(nlogn)O(n\log n)-type fill bound and O(n3/2)O(n^{3/2})-type work bound. This is the setting where the theory is strongest.

Recursive Vertex Separators

Recursive vertex separators are the most direct theoretical object behind nested dissection. A vertex separator removes a set of vertices so that the remaining graph is split into smaller balanced parts. If this can be done recursively with small separators, then the resulting ordering has provable fill and work bounds.

The condition for this guarantee is strong: every recursive subgraph must have a small balanced separator. This is true for planar graphs and many mesh-like graphs, but it is much harder to guarantee for irregular graphs.

This is why the theory is clean for structured finite-element meshes and grid-like matrices, but less clean for general sparse matrices.

Balanced Vertex Separator

The most relevant recent proof-based direction is balanced vertex separator approximation. This problem is closer to nested dissection than ordinary edge-cut partitioning, because sparse direct solvers usually need vertex separators.

Recent work by Kolmogorov and Spalding-Jamieson studies fast approximation algorithms for the minimum balanced vertex separator problem. Given a graph with an unknown cc-balanced vertex separator of size OPTc\mathrm{OPT}_c, their algorithm finds a Θ(1)\Theta(1)-balanced separator whose size is within a near-polylogarithmic factor of OPTc\mathrm{OPT}_c.

This is probably the closest modern theorem to replacing the separator step in METIS-style nested dissection with a separator algorithm that has a formal guarantee.

The limitation is that this guarantee is still about separator size. It does not directly prove that the final nested-dissection ordering has fill within a constant factor of the optimal fill.

Sparsest Cut and Balanced Edge Separator

Sparsest cut and balanced edge separator also have strong modern approximation results. These results are useful for graph partitioning theory and can guide partitioning algorithms.

However, they are one step away from sparse direct solvers. Sparse Cholesky and nested dissection usually need vertex separators, while sparsest cut is an edge-cut problem. A small edge cut does not always imply a small vertex separator with the same quality.

So this line of work is important, but it is not a direct proof that METIS, SCOTCH, or nested dissection will produce near-optimal fill.

Treewidth

Treewidth is another nearby formal target. If a graph has small treewidth, then it has small separators and admits an ordering with small maximum frontal clique size.

Modern treewidth approximation algorithms give real guarantees, especially when the treewidth parameter kk is small. This is useful for bounding the maximum front size in sparse factorization.

The limitation is that treewidth does not directly minimize total fill or total work. It mainly controls the largest front. Two orderings can have similar treewidth behavior but still differ significantly in total fill.

Minimum Fill-In

Minimum fill-in is the formal problem that most directly matches sparse Gaussian elimination. The goal is to add the fewest edges needed to make the graph chordal. These added edges correspond to fill entries created during elimination.

This is the cleanest mathematical target if the goal is to minimize fill. However, it is also a hard problem. There are exact and fixed-parameter algorithms, but they are mainly useful when the number of fill edges is small.

The approximation theory is also weak. Natanzon, Shamir, and Sharan gave an early polynomial-time approximation algorithm, but the guarantee is not a clean constant factor. Later hardness results by Cao and Sandeep show that strong general approximation guarantees are unlikely.

This explains why practical sparse ordering methods remain heuristic in general.

AMD and ParAMD

AMD and related minimum-degree methods are very important in practice. They often produce good orderings and are widely used in sparse matrix software.

However, their theoretical quality guarantees are limited. The minimum-degree heuristic has been studied for a long time, but there is no known general approximation ratio for the fill it produces.

Recent ParAMD work focuses mainly on parallelizing approximate minimum degree. It uses distance-2 independent sets to eliminate multiple vertices in parallel and reports strong shared-memory speedups. This is useful for performance, but it does not prove that ParAMD gives near-optimal fill.

So the guarantee here is mainly about parallel execution and practical efficiency, not about approximation to optimal fill.

METIS, SCOTCH, and Multilevel Partitioners

METIS, SCOTCH, KaMinPar, and similar multilevel partitioners are highly effective in practice. They use coarsening, initial partitioning, and refinement to produce balanced partitions with small cuts.

Recent work in this area often proves runtime, memory, or scalability properties. For example, some newer multilevel partitioners prove linear-time behavior under specific coarsening or sparsification rules.

But these results usually do not prove that the returned partition is close to the optimal cut. They also do not prove that the final ordering is close to optimal for fill or factorization work.

In other words, these tools are strong engineering solutions, but their partition quality is still mostly supported by experiments rather than general optimality theorems.

Main Takeaway

There are several different kinds of guarantees, but they apply under different conditions.

Recursive vertex separator theory gives strong nested-dissection bounds when small separators exist at every recursive level. Balanced vertex separator algorithms give the closest modern approximation results to a proof-based replacement for the separator step. Sparsest cut gives useful edge-partitioning theory, but it is not directly the same as vertex separation. Treewidth gives control over maximum front size, but not total fill. Minimum fill-in exactly matches fill minimization, but it is hard to approximate and only tractable in special fixed-parameter settings. AMD, ParAMD, METIS, and SCOTCH remain practical heuristics without general fill-optimality guarantees.

Conclusion

The clean conclusion is that graph partitioning theory gives strong guarantees only after the target problem is made precise. For sparse direct solvers, the most relevant theoretical object is the recursive balanced vertex separator, because it leads directly to nested-dissection fill and work bounds. Recent balanced vertex separator approximation work is therefore the most promising proof-based direction. However, there is still no general theorem saying that METIS, SCOTCH, AMD, or ParAMD produces an ordering whose fill is within a fixed factor of optimal. The current field has a clear gap: theory gives guarantees for separators, treewidth, and fixed-parameter fill-in, while production sparse solvers still rely on fast heuristics whose quality is mainly validated by experiments.
